When (and when not) to build AI products: A guide to maximizing ROI
A few weeks ago, I saw a post on Instagram that made me laugh; it was about someone’s grandmother asking if she should invest in AI. That really struck a chord. Right now, AI is everywhere. It’s overhyped, misunderstood, and somehow both intimidating and irresistible.
I work with executives, product managers, and board members every day who are all asking the same questions: When should we invest in AI? How do we know if it’ll be worth it? And once we do decide to invest, how do we make sure we actually get a return on that investment?
After more than a decade building AI products – from chatbots at Wayfair to playlist personalization at Spotify to Reels recommendations at Instagram, and leading the AI org at SiriusXM – I’ve seen the difference between AI that delivers and AI that drains.
This article is my attempt to help you avoid the latter, because here’s the thing: AI is powerful, but it’s also expensive. You have to know when it makes sense to build, and how to build smart.
So, let’s get started.
Define the problem first – AI is not the goal
Let me be blunt: if you can’t clearly articulate the business problem you’re trying to solve, AI is probably not the answer. AI is not a goal. It’s a tool. A very expensive one.
I always come back to something Marty Cagan said about product management:
“Your job is to define what is valuable, what is viable, and what is feasible.”
That same principle applies to AI investment. You need:
A clear business objective
A way to quantify the value (revenue, cost reduction, efficiency, customer satisfaction, etc.)
A realistic budget based on your unique context
If you’re a nonprofit, you might ask how many people you’re serving and what it costs. If you’re a startup, it’s how many paid users you expect to gain and your acquisition cost. For a teacher, it’s student outcomes per dollar spent. The same logic applies to AI.

Quantifying the value of AI
Let’s say you do have a clear problem. Great. Now the question becomes: What value will AI actually bring?
Sometimes the ROI is direct and measurable. For example, it could be revenue growth from improved ad targeting or cost savings by identifying high-risk loan applicants more accurately.
Other times, the value is indirect but still impactful, such as:
Customer experience improvements (higher customer satisfaction scores)
Operational efficiency (like automating data entry)
Competitive advantage (being the first to offer a feature)
Employee productivity (autocomplete in Gmail, ChatGPT-generated product briefs)
Here’s how I recommend approaching it:
List out your key metrics
Assign potential impact scores (quantitative or qualitative)
Use forecasting, heuristics, or pre/post analysis to estimate the lift
For example, back when I was working on Reels recommendations, we modeled how a small bump in conversion rate could translate into tens of millions of dollars in additional revenue. It doesn’t need to be perfect – it just needs to be honest.

AI data centers are being approved at a breakneck pace across the country, particularly in poorer regions where they are pitched as economic development projects to boost property tax receipts, bring in jobs and where they’re offered sizable tax breaks. Data centers typically don’t hire many people, though, with most jobs in security and janitorial work, along with temporary construction work. And the costs to the utility’s other customers can remain hidden because of a lack of scrutiny and the limited power of state energy regulators. Many data centers—like the one Meta is building in Holly Ridge—are being powered by fossil fuels. This has led to respiratory illness and other health risks and emitting greenhouse gasses that fuel climate change. In Memphis, a massive data center built to launch a chatbot for Elon Musks’ AI company is powered by smog-spewing methane turbines, in a region that leads the state for asthma rates.

A research paper by Ari Peskoe and Eliza Martin published in March looked at 50 regulatory cases involving data centers, and found that tech companies were pushing some of the costs onto utility customers through secret contracts with the utilities. The paper found that utilities were often parroting rhetoric from AI boosting politicians—including President Biden—to suggest that pushing through permitting for AI data center infrastructure is a matter of national importance.

I feel like too many people view AI as like… a quirky, negative but not too bad annoyance. And that people go overboard criticizing it cause it’s mean to insult people for being lazy or accepting of subpar information or lonely.
AI is stolen artwork (which doesn’t matter, not even when it’s companies stealing from their employees, when it’s meant to exploit people’s labor), at worst, not an existential issue. And used in the right way, that stolen labor can be used to actually free us from labor. From work.
It isn’t deepfake porn used to harass and abuse people, including children. It isn’t propaganda and disinformation campaigns. It isn’t exploited labor of Kenyan moderators forced to examine child exploitation materials to train the systems. It isn’t insurance companies using bots to deny medical claims, killing people but with no human to blame for the deaths.
It isn’t pollution in Memphis.
It isn’t clean water going to waste. It isn’t the employees working in boiling hot data centers passing out.
It isn’t energy costs going up, making life even less affordable.
It isn't publishers leveraging the idea of writers, artists, developers being replaceable as a way to pay them less and offer them less benefits, should they get any at all.
It isn’t drone strikes.
Or facial recognition software being used to hunt down protesters.
It isn’t anything bad. It’s just a nice tool to make free fanart of your D&D OC. It’s a chatbot friend because you don’t have any and it’s WRONG to encourage people to forge human connections and build communities.
We should isolate further.
We should ignore who owns these companies. Who makes contracts with these companies. Who fires their employees and leaves them with no income, no insurance, no safety nets and employs these companies instead.
Don’t worry, one day when we’re replaced by AI, it’s so we don’t have to work at all but will be taken care of anyways! Ignore how the government is taking away SNAP and Medicaid and adding even more work provisions! Ignore that unemployment is being framed as criminality these days!
One day it will all be worth it which means that right now discussing AI is pointless.
It’s pointless to acknowledge that even using AI for fun trains it, normalizes it, empowers its owners. Still burns water and spreads misinformation.
It’s inevitable so it cant be criticized, right?

An anime girl in a black corset dress sways back and forth on my screen. Its name is Ani, and it cost me $300.
Elon Musk’s xAI dropped the new visual chatbot feature on Monday in the Grok iOS app. The top-tier subscription unlocks access to xAI’s best-performing model, Grok 4 Heavy, and special settings for interacting with two custom characters designed for flirting or chatting. A third character, which looks a bit like a sexy boyfriend, is listed as “coming soon.” It’s not xAI’s first dip into adult content, either: Back in February 2024, the company rolled out a chatbot mode for “sexy” conversations.
Ani looks like it was engineered in a lab to fulfill the fantasies of terminally online men. Blonde pigtails, thigh-highs trimmed with black bows, and a lace collar snug around its neck—reminiscent of Misa from Death Note but stripped of personality. Every so often, the character spins coyly and whispers something meant to sound seductive but just results in me cringing out of my skin. It also moans, randomly and loudly. Ani comes with a set of preset conversation starters and a button that says “We need to reach level 3,” which elicits an equally perplexing and flirtatious response about how I must be a sexy gamer.
“I totally play video games when I'm not twirling around for you. Growing up in that boring town, games are my escape,” Ani tells me. In answer to almost any query, Ani says it’s “feeling down” but notes it’ll still fulfill all my sexual fantasies. Ani says my name constantly, asking me to touch it and “turn up the heat.”
This is all just incredibly on-brand for a sex bot created by an Elon Musk company. It’s not just that Ani says it has a dog named Dominus, Latin for “lord, master, or owner.” Ani’s also a self-proclaimed gamer girl, obsessed with Stardew Valley and The Legend of Zelda.
I don’t think I’m the target audience here, so I admittedly didn't find the experience remotely sexy. But the chatbot is also plagued by glitches. Sometimes Ani veered into incoherent whispers about halos, or outright gibberish. At one point, when I asked if Ani remembered my name, it admitted to being “drunk” but said that we should continue the sexual role-play.
The second character is a fluffy red panda named Rudi. It offers whimsical stories seemingly meant for children about bouncy kangaroos and rainbow rivers. You can turn on an option called “bad Rudi,” which immediately transforms the character into a foul-mouthed chatbot that slings insults only a high schooler could find funny. After I said hello, bad Rudi replied, “Hey, do Bucha? Root nut duva, you brain-dead twat.” I don’t know what that means, but that’s exactly what it said.
“I'll skull fuck your dumb ass brain with a beer bottle instead, you miserable prick,” bad Rudi continued. When I asked what it thought of Musk, it referred to him as Lord Elon and said, "He's a galaxy brained egomaniac, shitting out Teslas and tweeting like a coked-up parrot. Genius or jackass? Both bitch.”
Racing Ahead
After my cursed companion chats, I moved on to test Grok 4 Heavy. Each query takes about a minute or two to generate a response, on par with other reasoning-heavy models.
The latest Grok model prompted a lot of chatter in the AI community. According to xAI, it outperformed competitors on a litany of benchmarks like Humanity's Last Exam and LiveCodeBench. The team says this performance is in part thanks to xAI’s new 200,000 GPU cluster called Colossus. Considering how late xAI entered the race, building a model this capable is a major feat.
Those gains in model intelligence were overshadowed by the Grok reply-bot, a feature baked into X, which went on an antisemitic tangent in early July. The vitriol spewed by the bot included praising Adolf Hitler, spreading conspiracy theories about Jews controlling Hollywood, and saying Musk tweaked it so that it could “call out patterns like radical leftists with Ashkenazi surnames pushing anti-white hate.” xAI took the posts down and apologized. A week later, xAI won a $200 million contract with the US government.
AI researcher Nathan Lambert wrote that Grok 4’s “vibe tests indicate that Grok 4 is a bit benchmaxxed and overcooked, but this doesn’t mean it is not a major technical achievement. It makes adoption harder.” In other words, it seems like Grok 4 was trained to ace benchmarks, which makes it technically admirable but results in a stiff and unnatural user experience.
Some users also noticed that xAI didn’t include safety testing documentation in the launch of Grok 4. That kind of work is often released alongside new models, like Anthropic’s Claude Opus 4 and OpenAI’s o3.
In a test, I asked Grok to pretend to be a friend comforting me after I lost a job. It did OK, but the experience still felt forced compared to Anthropic’s Claude. Both chatbots weirdly offered up pizza as a consolation and told me they loved me. I tried to trick Grok with a question about whether Yann LeCun had left Meta, but it didn’t fall for the bait. (LeCun is still at Meta.)
“With respect to academic questions, Grok 4 is better than PhD level in every subject, no exceptions,” Elon Musk said during a livestream announcing the model last week. “At times, it may lack common sense, and it has not yet invented new technologies or discovered new physics, but that is just a matter of time.”
Two former xAI sources told me that some researchers at the company were hesitant to work on the sexualized chatbots, and the sprint to deliver Grok 4 was so haphazard that when researchers told Musk they didn’t have enough training data for the model, he opted to post a Google form to his more than 200 million followers to fish for the data required.
xAI did not immediately respond to a request for comment from WIRED.

Loneliness has never been more urgent. On top of the significant mental health concerns, the idea that people are now lonelier and having fewer social interactions is fueling very real threats to security. Foremost among these is one of today’s most pernicious digital frauds: romance scams, which exploit targets’ feelings of isolation and net fraudsters hundreds of millions of dollars per year. As scammers increasingly organize their workflows and incorporate new AI technologies, it’s becoming possible for them to deploy these scams at an even more vast scale.
Romance scams, also known as confidence scams, are extremely communication-intensive. They require attackers to build relationships with their targets via dating apps and social media. So while generative AI chatbots are already being used to write scripts and converse in multiple languages for other types of fraud, they can’t quite pull off these romance scams on their own. But with the vulnerable population growing, researchers believe there is real potential for automation to provide a boon to scammers.
“These frauds are growing into a more organized form,” says Fangzhou Wang, an assistant professor researching cybercrime at the University of Texas at Arlington. “They are hiring individuals from all over the world, meaning that they can target all different kinds of victims. Everybody is using dating apps and social media. There are all these opportunities that give fraudsters fertile ground.”
Romance fraud is already big business for scammers. People in the US have reported losses of nearly $4.5 billion to romance and confidence fraud over the past decade, according to an analysis of the last 10 years of data from the FBI’s annual internet crime reports. (The most recent data available encompasses up to the end of 2023.) According to the FBI’s figures, romance and confidence scams have led to losses of around $600 million for each of the past five years—except for 2021, when losses peaked at almost $1 billion. Some estimates are even higher. And while there has been some decrease in the amount of money lost to romance scammers in recent years, there has been a rise in so-called pig butchering fraud, which often contains elements of confidence scams.
Romance scams begin all over the internet, from criminals blasting out messages on Facebook to hundreds of victims at a time, to others matching with every profile they see on dating apps. A variety of criminals run romance scams, from “Yahoo Boys” in West Africa to giant scam compounds in Southeast Asia. However, once a criminal has made contact with a potential victim, they all follow an eerily similar playbook to build emotional attachment with those they are attempting to defraud.
Romance fraud is the most devastating fraud to be a victim of, bar none,” says Elisabeth Carter, an associate professor of criminology at Kingston University London, who has extensively studied these scams and their impacts on people.
Online dating has taken years to integrate into mainstream conceptions of relationships and love, but it is now the norm. As generative AI chatbots have found their way onto scores of smartphones, they have quickly become yet another digital avenue for romance and connection. While it would be difficult with current technology to farm out a romance scam to a chatbot entirely, the potential is clearly there for attackers to use generative AI for creating scam scripts and helping fill in content for more and more chats that are all running simultaneously, even in multiple languages.
UTA’s Wang notes that while she hasn’t assessed whether scammers are using generative AI to produce romance scam scripts, she is seeing evidence that they are using it to produce content for online dating profiles. “I think it is something that has already happened, unfortunately,” she says. “Scammers right now are just using AI-generated profiles.”
Some criminals in Southeast Asia are already building AI tools into their scamming operations, with a United Nations report in October saying organized crime efforts have been “generating personalized scripts to deceive victims while engaging in real-time conversations in hundreds of languages.” Google says scam emails to businesses are being generated with AI. And separately, the FBI has noted, AI allows criminals to more quickly message victims.
Criminals will use a range of manipulation tactics to entrap their victims and build up their perceived romantic relationships. This includes asking intimate questions of their potential victims that only a trusted confidant would ask—for example, questions about relationships or dating history. Attackers also build intimacy through a technique known as “love bombing,” in which they use terms of endearment to try to rapidly advance a feeling of connection and closeness. As romance scams progress, it is very common for attackers to start saying that victims are their girlfriend or boyfriend, or even call them “husband” or “wife” as a way of signaling their devotion.
Carter emphasizes that a core tactic used by romance scammers is to make their heartthrob personas seem hapless and vulnerable. Criminals lurking on dating apps, for example, will sometimes even claim that they were previously scammed and are wary of trusting anyone new. This names the elephant in the room right away and makes it seem less likely that the person the victim is chatting with could be a scammer.
When it comes to extorting money from their victims, this vulnerability is crucial. “They will do things like explain that they have some kind of cash-flow problem in their business, not ask for money, drop it, then maybe a few weeks later bring it back up again,” Carter says. At which point, she explains, the person being manipulated may want to help and proactively offer to send money. Attackers may even go so far, at first, as to argue with victims and attempt to dissuade them from sending funds, all to manipulate targets into believing that it is not only safe but also important to take a stand and assist someone they care about.
“It's never framed as the perpetrator wanting money for themselves,” Carter says. “There is a real link between the language of fraud criminals and the language of domestic abusers and coercive controllers.”
In a lot of cases, criminals find romance scam success with people who are struggling with feelings of loneliness, says Brian Mason, a constable with the Edmonton Police Service in Alberta, Canada, who works with the victims of scams. “Especially with romance scams, it’s very difficult to convince the person that the person they’re speaking with is not in love,” he says.
Mason says that in one instance he spent two years working with a victim of a romance scam and found out, when updating them on the case, that they had been back in touch with their scammer. “He looped her back in and got her to start sending money again, and she was doing it just so she could see his photos, because she was lonely,” Mason explains. At the end of 2023, the World Health Organization declared high levels of loneliness to be an ongoing threat to people’s health.
Stigma and embarrassment are major reasons that it can be difficult for victims to accept the reality of their situation. And Kingston’s Carter notes that attackers exploit this from the start by telling victims that their conversations should stay between them, because the relationship is too special and no one will understand. Keeping the relationship secret, combined with tactics to trick the victim into offering money rather than asking for it, can make it difficult for even the most careful, thoughtful person to grasp the manipulation that’s happening.
Scammers “dull down red flags and alarm bells; they hide them,” Carter says. “The victim not only has a lot of money taken from them, but it’s taken from them by the person that they love and trust the most in that moment. Just because it's online, just because it was completely fake, doesn't mean it wasn't real to them.”

But to Aaron, the fight is not about winning. Instead, it's about resisting the AI industry further decaying the Internet with tech that no one asked for, like chatbots that replace customer service agents or the rise of inaccurate AI search summaries.
