You need to optimize your LLMs to get from prototype to production
Creating an impressive AI demo that works part of the time can be easy, but to get to production, you’re always going to need to iterate and improve your LLM application’s performance. The three most common techniques for improving your application are prompt engineering, retrieval augmented generation (RAG) and fine-tuning.
Prompt Engineering: Tailoring the prompts to guide the model’s responses.
Retrieval-Augmented Generation (RAG): Enhancing the model’s context understanding through external data.
Fine-tuning: Modifying the base model to better suit specific tasks.
A common mistake is to think that this is a linear process and should be done in that order! But RAG and fine-tuning solve different problems and the usual path is more iterative, alternating between all three techniques depending on what’s the limiting factor to your application’s performance. You should iteratively ask yourself two questions:
Are the problems because the model does not have access to the right knowledge? — if yes, then context optimization (prompt engineering and RAG) are your best bets.
Is the problem accuracy or formatting? — if yes, then you likely want to consider fine-tuning.

But first, you need evals
“If you can’t measure it, you can’t improve it.” — Peter Drucker
The most crucial step in the optimization process is setting up a solid evaluation framework. Without a clear understanding of your model’s performance, it’s impossible to tell if you’re making progress. The goal of evaluation is not just to identify where the model falls short, but also to uncover actionable insights that guide your optimization strategy. Whether you’re refining prompts, tweaking RAG, or fine-tuning the model, evals should help you know what to try next.
Here are some of the most common evaluation techniques:
Outsourced human annotation: AKA paying people to tell you whether something is good or bad. It’s often expensive, slow and challenging to ensure consistent quality.
Internal human review: Having your team internally review outputs ensures quality but can be slow and resource-intensive.
Model-based evaluation: Using another LLM to evaluate your system’s performance. This has become increasingly effective with powerful general models.
Code-based evaluation: Implementing custom heuristics defined in code to assess specific aspects of the model’s output.
Accuracy Metrics: If you have clear targets, metrics like F1, precision, recall, and BLEU can provide objective measures of your model’s accuracy.
End-user feedback and A/B testing: Often the feedback that matters most! This can include direct user responses as well as implicit actions indicating user preferences. However, it requires having an early version of your system available to users.

For RAG specifically, information retrieval based scoring can be applicable. Open source eval frameworks like RAGAS can help evaluate retrieval-based scoring.
Do prompt engineering first (and last!)
Prompt engineering should nearly always be the first thing you explore in optimizing your LLM performance. In fact, it should be one of the things you also re-explore after RAG, fine-tuning, or other advanced techniques, given how core the prompt is to LLM generations. Even with prompt engineering alone, you can make sufficient inroads on the two axes of optimization. If the issue is with the output, you can constrain the response to be JSON, or to follow a specific format with tool calling. You can also add in examples of the task being performed (‘few-shot learning’) which can help the model understand the task better.
If the issue is with context, you can prompt-stuff (technical term) with all the relevant and maybe-relevant context it needs. The main limitation is the size of the context window and what you’re willing to pay in cost and latency.
Evaluate and version your prompts to make sure you’re making progress
When prompt engineering, keeping track of changes to your prompts and parameters is key. Every adjustment should be recorded and evaluated systematically, helping you understand which changes improve performance and which don’t.
At this stage it’s helpful to have a specialized prompt development tool like Humanloop. A prompt editor that is paired with an evaluation framework can systematize iteration and allow engineers to more easily collaborate with domain experts.
After prompt engineering, you should identify where the largest gaps are. From this, you can decide whether to explore RAG or fine-tuning.

Fine-tune to optimize performance, improve efficiency and become defensible
Fine-tuning is continuing the training process of the LLM on a smaller, domain-specific dataset. This can significantly improve the model’s performance on specialized tasks by adjusting the model’s parameters themselves, rather than just changing the prompt.
Think of fine-tuning like compiling code. It’s an optimization step for something that’s mostly already working
One of the biggest challenges with fine-tuning is having the right dataset and curating it. This is an area where having the right infrastructure can be very helpful. A very common workflow is to use your evaluation data to filter your production logs to find the best performing examples and then fine-tune on that data. This process can often be repeated multiple times with continued improvement. Tools like Humanloop help here because they allow you to log user data from your production applications alongside evaluation.
Why fine-tune?
There are two main benefits to fine-tuning:
Improving model performance on a specific task
Fine-tuning means you can pack in more examples. You can fine-tune on millions of tokens, whereas few-shot learning prompts are limited to 10s of thousands of tokens, depending on the context size. A fine-tuned model may lose some of its generality, but for its specific task, you should expect better performance.
Improving model efficiency
Efficiency for LLM applications means lower latency and reduced costs. This benefit is achieved in two ways. By specializing the model, you can use a much smaller model. Additionally, as you train only on input-output pairs, not the full prompt with any of its prompt engineering tricks and tips, you can discard the examples or instructions. This can further improve latency and cost.
Best practices for fine-tuning
For fine-tuning to work best you should start with a clear goal and a relevant, high-quality dataset. It’s crucial to fine-tune with data that exemplifies the type of output you need. Moreover, iterative testing is vital – start with small, incremental changes and evaluate the results before proceeding further. It matters a lot what you fine-tune on!
Use Retrieval-Augmented Generation (RAG) if the issues are due to context
When you’re dealing with LLMs, sometimes the challenge isn’t just about how the model generates responses, but about what context it has access to. The models have been trained on mostly public domain content from the web; not your company’s private data, nor the latest information from your industry.
This is where Retrieval-Augmented Generation (RAG) comes into play. It’s combining the capabilities of LLMs with the context of external data sources.
Example RAG system where the user’s query is used to fetch relevant documents from a knowledge base before both are inserted into the prompt for the LLM to synthesize the answer.
Setting up RAG
The first thing to do is to demonstrate performance with some handpicked few-shot examples. After which you may wish to operationalize this with a system for picking out those examples.
RAG can be as simple as creating a prompt template and inserting dynamic content fetched from a database. As LLM applications often work with natural language, it’s very common to use semantic search on a vector database, such as Qdrant, Chroma and Pinecone. Tool calling is a way to use the LLM to create the structured output necessary to directly call systems like traditional SQL databases. And Prompt Tools enable you to conveniently hook up resources into your prompts with having to build any data pipelines.
However, RAG is rarely a plug-and-play solution. Personally I prefer Redux...
Andy Hutchins: I can't believe I truly love a Pussycat Dolls song in 2020, but I do. And how unlikely that was: "React" is penned by three Brits with no American profile whatsoever, Nicole Scherzinger (who got credits on "Buttons" and "I Don't Need a Man," but also, uh, "Whatever U Like"), and a fifth-string Scandinavian producer whose beat begins by riffing on what sounds like the immortal StarTropics theme and never gets too much more adventurous than some tick-click drums. It works so damn well together, though, with Scherzinger in full control of her range and tone, the well-written ("masochistic" sounds genuinely good on a pop song!) lyrics conveying the desired message -- "I know what I want, nice guy, and I'll push your every button to get it" -- and the production keeping spaces open for filigrees like the panting after "lose my breath" and a "rrahhh" signifying a feline belligerence. Maybe "React" is too cool for the States (put Dua Lipa's name on it and it's a top-40 hit!), and maybe it lacks the show-stopping bridge or skyscraping runs that a better singer would have permitted, but this is the work of grown-ass women who know they're good at their jobs because they've been doing them for 15 years, and that comes across in the competence and confidence on display. Brad Shoup: It's good to have Scherzinger back. I love the smeared dance-pop beat, and the way the measured syllogism of the chorus unravels in a heap. (I'm also a fool for a final chorus that introduces a new set of words.) She sounds marvelous -- cool and strong, and one of the few people who could put this push-pull lyrical trope over. [9]
Scott Mildenhall: Dead air is a crime, so heaven knows what led to the jarring snatches of silence in "React", but they're at least not the most jarring thing about it. In this age of SEO literalism, in which lyrics are assumed to be autobiography, and the vanguard of subtext is headed by Genius annotations, it's odd to have something sound like empowerment while reading like flawed character study. Should "sometimes I want to fight" sound like an affirmation? It's not the Pussycat Dolls' fault that pop songs are rarely granted nuance, and that's a problem that won't be new to them; on the plus side, most people won't even notice the lyrics. They could be lorem ipsum and this would still be solid: a tightly manoeuvred skeleton run of a standard that has remained surprisingly high. [7]
Michael Hong: For every rush of a line ("you're turning me cruel 'cause I'm just wanting you to react"), there's another that Nicole Scherzinger draws out, like a tantalizing taunt ("so call me masochistic"). This push-and-pull of urgency then withholding gives "React" its alluring sound, intensified by the track's strobe light pulse of a beat and the rest of The Pussycat Dolls' breathy harmonizations and ragged sighs. The only downside is the production of Scherzinger's voice in the opening verse, which sounds as if it's been pitched downward for a more sultry sound but just serves as a reminder of the manufactured nature of the Dolls. Will Adams: I have to applaud The Pussycat Dolls for re-upping their dubious premise of a girl group where only one of them sings over a decade after the fact. In 2005 it felt hugely cynical, as if Nicole Scherzinger's solo break had been pre-baked into the recipe. This late in the game, it has a "sure, why the fuck not?" energy about it. The surprise, however, is how much the resultant song has going for it. It actually manages to do the Zedd tick-tock chorus correctly (i.e. not punish the mix with the clock sounds), it sports a nimble bassline that evokes "Body Language", and Scherzinger is far more engaging a vocalist than Dua Lipa, who would have received this song in a slightly diverging timeline. But in the end, that gossipy periphery will endure, and it'll be just as annoying and just as much a detriment to the music. [6]
Edward Okulicz: The only Pussycat Dolls song I love unreservedly is "I Hate This Part," which I love for its desperation and earnestness. This has some of the same emotional connection in lyric and performance, where Nicole Scherzinger grew outside the Dolls' gimmick of a burlesque troupe gone pop for a song or two. Now it's a song or three. [7]
Katherine St Asaph: The Pussycat Dolls were best when they got out of character. For every expectedly raunchy single like would-be Tori Alamaze vehicle "Don't Cha" and cod-Middle Eastern "Buttons," they released something like "I Hate This Part," a precisely observed ballad ("We're driving slow through the snow on 5th Avenue" is the biggest clash of first line and band image since ABBA's "no more carefree laughter, silence ever after") sung like a wringer, or "Hush Hush" (an early Ina Wroldsen co-write, an early EDM-disco song, really about 10 years ahead of trends). Much like the Chainsmokers smuggled female singer-songwriters back into the zeitgeist, PCD made surprisingly emotive pop for a Svengali-assembled burlesque group called The Pussycat Dolls in which only one person sings. "React" is in this mode, a mussed-up "All Your Gold": club sleaze over a kitchen drama, about a relationship that's mundanely meh. The track sounds great:, too: brash brass, a beat that sounds like it's being continuously clipped out of paper with scissors, Nicole Scherzinger's vocals (maybe others', if you're credulous) alternatively so throaty and rich they're almost anachronistic, and airy -- the post-chorus sounds piped out of a smoke machine. It also sounds utterly out of place in 2020, but maybe to you that's a compliment. [8]
Alfred Soto: On first listen the vocal pizzazz reminds me what the pop charts lack. Repeated listens reveal an outdated way of dealing with relations between the sexes, particularly the way the high harmonies settle around the chorus. The tick-tock relentlessness of its hook grates on me too. Still, should you hear it on the radio, rejoice. [6]
Alex Clifton: There is a whole generation of girls who are going to listen to this and realize they are not straight, and I am extremely excited they have this opportunity. [9]
Leah Isobel: "React" is a portrait of a woman as uncontrolled emotion, which fits right in with the Pussycat Dolls' M.O. Their most distinctive maneuver in the 2000s was the push-pull between internalized misogyny and Bush-era empowerment. This dialectic made the infighting rumors a feature rather than a bug, but in 2020, it's gauche for women to fight each other for our entertainment, so their rage has to go elsewhere. It's a victory for feminism, maybe, but it doesn't change the underlying psychodrama of their work: The track portrays its performers as sexy but crazy, and doesn't do much to excavate the whys. And yet, despite or perhaps because of its retrograde inclinations, I won't not bop to this in the club. What can I say? I'm sexy but crazy, too. [6]

Why you should read digitally

William Howard Gass, author of the article “In Defense Of The Book”, argues that printed books have great value that e-books can never give by saying:
“Words on a screen have visual qualities, to be sure, and these darkly limn their shape, but they have no materiality, they are only shadows, and when the light shifts they'll be gone. Off the screen, they do not exist as words. They do not wait to be reseen, reread; they only wait to be remade, relit. I cannot carry them beneath a tree or onto a side porch; I cannot argue in their margins; I cannot enjoy the memory...”
He wrote this article, however, in 1999.
Digital technology has made tremendous progress since then.
In 1999, the Google search engine and Bluetooth were officially launched. The idea of website blog was popularized.
In 2002, 75% of journals are online in Science Citation Index®.
In 2004, the term Web 2.0 begins to appear frequently. Google Books starts working with university and public libraries to digitize books from their collections and make them searchable on Google.
In 2007, iPhone was released, continues the shift to handheld digital devices. The same year, Amazon released the Kindle, it sold out in 5 and half hours.
In 2009, The World Digital Library was launched.
In 2010, Apple launched the first iPad.

In 2018, people out of every 7 in the world own a cell phone. Digital information is more accessible than ever.
Since more and more people are now reading digitally rather than reading printed books, the “E-books or printed books?” debate is intensified.
As a book lover who has changed the way of reading only from last year, I understand why people love classic books, but I also see so many benefits of reading digitally. Here I’d like to give some ideas about why you should read e-books.
More Convenience
E-readers are much lighter and more portable than printed books! With an e-reader, you can store all sorts of books in one device and carry it anywhere.
Take a kindle as an example:

You can also calculate the precise weight of a book at Bookmobile.
This is one of the main reasons why I use e-readers. I used to have a bookshelf full of heavy printed books, but I travel a lot and cannot take many books with me. Now I am able to store countless books on my kindle or my phone.
More Functions
E-readers have more humanized design than regular books.
You can change font size as you like.
You can read e-books under any light conditions.
You can highlight words and put bookmarks without other tools.
You can use dictionary and annotations when reading Old-English or in a second language.
You can also share your thoughts with the readers around the world reading the same book.
You can add books to wishing list first and get notifications for book sale promotions.

Although some argue that personalized recommendations of e-books on digital stores may from a “filter bubble”, I personally do not think this argument stands: we do have preferences, one would search for the types of books he or she likes whether in a bookstore or online.
Better Durability
E-books are more durable than paper books.
When you lose a printed book, the only way to bring it back is to buy a new one. But you’ll lose all your notes. While for e-books, you can always restore your books and reading progress from the cloud using other devices.
Unlike printed books, e-books in the cloud do wear out, they cannot be torn up or stolen.
Better Accessibility & More Collections
In the networked period, fast peer reviews, open resources, and rich collections brought by digitalization are the keys towards intellectual achievements.
Before the World Wide Web, some scientific discoveries ( eg.Mendel's concept of the laws of genetics) took a long time to be noticed by the world due to old methods of transmitting and reviewing academic works. With e-journals, scholars around the world are able to view each other’s works and give comments.
Nowadays, most journals are published online. Ironically, Gass’s work “In Defense Of The Book” is also shared online for students to download.
Also, as mentioned earlier, antique book collections need to be kept carefully from outside contaminations, some even need to be stored in special environments. Therefore, ordinary people like you and I do not have access to them until we have the World Digital Library, which makes available on the Internet, free of charge and in multilingual format, significant primary materials from all countries and cultures. As Robert Danton suggests, the democratization of knowledge can be achieved by digitizing and opening up collections.

Since e-books can be published at a relatively low cost, they are much cheaper than printed books. Readers can save a lot of money in a long term.
I used to read only classic paper books, but I often cannot afford all the books on my wishing list. I had spent a large amount of money on books before I bought a Kindle last year. The $100 I spent on a Kindle was the best investment I have ever made: I now read around 20 e-books per month and have saved money far more than $100.
More Eco-friendly
According to Epublishers Weekly, every 200 million ebook downloads can save 3,200,000 trees. Printed materials, on the other hand, waste a lot of resources.
“One year of Sunday newspapers, produced by the New York Times, is responsible for the destruction and consumption of more than 3,900,000 trees.”
Digital publishing and reading brings many environmental benefits, including:
Reducing paper consumption and save trees
Saving money and energy used in book production
